Why Your Data Stack Won't Last - And How To Build Data Infrastructure That Will

As a consultant, I have been called in to review and, in many cases, replace dozens of half-finished, abandoned, and sometimes forgotten data infrastructure projects.

The data infrastructure in a few cases may just need a little tweaking to operate effectively, but other times the project is either so incomplete or so lacking in a central design that the best thing to do is replace the old system.

Trust me, I’d love it if I could come into a project and simply change a few lines of code, and then everything would just work. However, so many projects are filled with unclear design decisions or resume-driven development that were never rooted in good planning.

Of course, business stakeholders may have also push to get things done quickly. Forcing data teams to take on tech debt that will never be fixed. Don’t get me wrong, you want to get things done and move projects forward. But taking on technical debt is a decision that needs to be made intentionally. Otherwise, like in resume driven development, your data infrastructure might disappear.

This begs the question.

How do you ensure the data infrastructure you’re building doesn’t get replaced as soon as you leave in the future?

In this article I wanted to dive into the problems I often come into that require me to replace the current data infrastructure and how you can avoid it.

So let’s dive in.

Resume And Vendor Driven Development

When you design a new system, it shouldn’t be driven by a vendor or your resume . Don’t get me wrong, if you have a solid, reliable base for your data infrastructure , testing out the occasional POC with new tools isn’t a bad idea.

The problem I find is that many data teams get thrown into having to design data infrastructure with little experience actually setting up one in the past. Don’t get me wrong, we all start with no experience. But it can be difficult to assess what all the nuances of different tooling and designs can be.

In turn, many of them will look up articles to see what some of the big tech companies are doing or what a vendor might recommend. This can lead to design choices that likely won’t fit your use case.

One great point that was made by an ex-manager in analytics I was just talking to was that it can be easy to pick an ETL or data pipeline tool that sounds good on paper. The account executive and sales engineer will put together the perfect pitch and POC.

But eight months into a project there is a key blocker that the tool either didn’t disclose or could only be found out with experience. Honestly, the vendor themselves might have not even known the limitation.

A similar point can be made when you’re trying to design your overall architecture. If you try to follow what a large tech company is doing, it might be a bad fit for your company.

You need to be very intentional with your core design.

How To Avoid Resume-Driven Development 

Talk to people who have used the vendor - Most data engineers are happy to share their thoughts on various tooling. Thus, try to find a mix of different data engineers and architects that you can ask about their experience with the tooling. Some will tell you flat out, don’t use said tool while others will sing the praises of some tools.

Read agnostic sources - This can be research papers, non-affiliated consultants, books, etc. Just read everything with a grain of salt!

Start with the business goals - It can be tempting to find the right job for the tool. After all, we all want to put the current “it” tool on our resume. However, when you do start looking to develop data infrastructure , your first goal should be to work with the business to understand what they actually want their outcomes to be. Then you will want to start to take a measured approach to finding the right tools or designing the right system.

Key Person Dependency Issues

One of the constant issues many companies face, especially the smaller ones, is a key person dependency issue . This manifests as either a single key developer or perhaps a small team that all decide to develop the data infrastructure that will be difficult for future teams to maintain or even understand what is going on.

This could be because the prior team didn’t document their design, or only documented it for themselves.

Sure, they have built data infrastructure that works and solved the businesses current problems. They maintain it, and no one asks questions.

Perhaps no one realizes that one of the team members has to wake up at 6 AM every morning to check and ensure all the reports and tables have been created.

That all works until the day they leave.

Then the data infrastructure may hold for a little bit, but eventually, problems arise. Perhaps the company has hired a replacement data team but they may eventually hit the limit of what they can actually support.

This was a major issue for many of my past clients. Around ⅓ over the past few years reached out for my services due to this.

In one example I came in and found a data vault project that wasn’t being used. It actually had pretty good documentation. However, the team had taken so long and hadn’t fully completed the project which led to their dismissal. What’s worse is because the project was never completed several analysts had to work weekends to create key reporting for the board.

For this specific case, we massively simplified what they had built and built a simpler data warehouse that a smaller team could maintain.

And of course made sure the reporting was automated so the analysts could stop working weekends.

How To Avoid Key Dependency Issues

Documentation - Make sure the documentation you create isn’t just written for you, but for someone who has never seen your code before. In particular, highlight key decision points starting with why you may have picked certain tooling, why you may have implemented logic in certain places, etc.

Cross-training(where it makes sense) - For larger teams consider cross-training. This can also include semi-technical employees from other teams. I am not saying they will or should replace the engineers. But from my perspective, as a consultant , it's been great to walk in and talk to marketing analysts or operational analysts who have some bearing on why the system was developed the way it was.

Building Data Infrastructure Without The Business In Mind

In several of the projects I have come into, the communication between the stakeholders and the data teams had either broken down or never existed. 

The data team had gone off for several months without ever really delivering anything that could be reviewed by the business. Then by the time stakeholders saw the results it just wasn’t what they were looking for.

Your stakeholders need to be brought into what you’re building. Let me give an example. One of my clients I came into work with had a data warehouse. It technically functioned.

But within a few days, I realized no one was using the 2-3 dashboards that were being supported by the data warehouse .

Well, a combination of reasons but one was it was never actually built with the stakeholders.

So they didn’t find the end results helpful.

This section’s topic is likely what kicked off my inspiration for this article. There is so much data infrastructure that is built in a silo without being tied to the business. All of which eventually leads to failed projects and data infrastructure not lasting.

How To Build With the Business 

Start with business outcomes - I already said something similar above. But it’s always worth repeating. You don’t want to build infrastructure for infrastructure’s sake. So before starting a project, be clear what you’re trying to do in terms of improving the business.

Keep the business in the loop - It can be very tempting to not have meetings reviewing your dashboards or analyzing the metrics. After all, you have to get work done. The problem arises when at the end of your 3-6 months of development you finally show off your end-product and it wasn’t even close to what the stakeholders wanted.

Building Purposeful Infrastructure

Your data infrastructure doesn’t have to be a mess so to speak, or perhaps I should just say it doesn’t have to be difficult for a future developer to understand what is going on under the hood. My best experience in learning how to program was when I worked for a company and opened up their code base and I understood what was going on. 

The abstractions weren’t so deep that I couldn’t trace them, and there were clear standards implemented in naming conventions.

Honestly, it was just a lot of little things done right.

A well-thought-out and simple system.

Naming that people can understand.

And documentation that isn’t filled with acronyms and assumptions.

That can help ensure that years into the future, your data infrastructure is still around.

Man City vs Manchester United LIVE: Community Shield result and reaction after Akanji scores winning penalty

Manchester City secured their first Community Shield win since 2019, with Manuel Akanji scoring the decisive eighth penalty against local rivals Manchester United .

The game started off in a slow fashion, with Alejandro Garnacho breaking the deadlock in the 82nd minute with a stunning strike, before Bernardo Silva equalised with just a minute of normal time to take the game to penalties at Wembley.

There were just two misses from Bernardo Silva and Jadon Sancho in the first five penalties, which included a goal from Ederson , before it went to sudden death.

Jonny Evans did not look confident stepping up for his side’s eighth and ended up firing over the bar, while Akanji rolled his into the back of the net to give Pep Guardiola’s side the victory.

There are times in recent years when it has felt that  Manchester City have had an annual ritual . Lose the  Community Shield , win the Premier League. Their seasons  started in disappointment and ended in glory . But, the runners-up three times in a row have finally got their hands on a trophy they value less than most. City came from behind in the game and then the shootout, showing resilience and a determination to beat  Manchester United   with a weakened team.

There was a redemptive moment for Manuel Akanji, who scored the winning spot kick in a marathon shootout. He had  missed from 12 yards when Switzerland exited Euro 2024  to England but, after seven teammates had stepped up, was called upon to apply the final touch. There was a starring role for Ederson who, with City behind in the shootout, palmed Jadon Sancho’s penalty onto the post and then calmly scored himself. There was a remarkably eventful cameo from Bernardo Silva, who equalised in the 89th minute only to then miss City’s first penalty.

Pep Guardiola  said  Manchester City  will discuss signing another striker to replace  Julian Alvarez .

The Argentina international, who scored 36 goals in his two seasons at City,  will complete an £82m move  to  Atletico Madrid .

Guardiola revealed he gave his approval to the World Cup winner’s move and accepted Alvarez probably wanted more first-team football after understudying Erling Haaland.

Aaron Wan-Bissaka  is closing in on a transfer to  West Ham  as his five-year stay at  Manchester United  is nearing an end.

Talks between the clubs are progressing well and United are expected to move for Bayern Munich’s Noussair Mazrouai if the right-back is sold.

Wan-Bissaka, who has one year left on his contract at Old Trafford, is likely to cost around £17m.

It had been thought personal terms could be an issue, given his salary at United, but there is growing confidence that he will move on.

Pep Guardiola  was staring at the start of a season that could span 48 weeks for  Manchester City . He has often sounded the alarm about the impact of a crowded schedule for players and the Club World Cup will only add to it. He also reflected on the challenge City face to retain the Premier League title. “Everyone wants the crown that we have worn for four years,” he said. “I understand it.” Some of his rivals do more than merely want it: they seek to strengthen to secure it.  Manchester United have  been more active in the transfer market . “They’ve done it for many years, but it’s not news; just when City spend,” noted Guardiola. It could be seen as an observation or a dig.

And if it has been a quiet summer in the blue side of Manchester, with only Savinho arriving,  Julian Alvarez ’s  departure to Atletico Madrid  raises the question if City will be weaker this season. “I’m very pleased with the squad for the quality of human beings and the quality,” countered Guardiola. He has touted the introduction of the teenager Nico O’Reilly to the squad and the return of James McAtee from loan at Sheffield United, while admitting Sergio Gomez, another fringe figure, is a loss.

Manchester United  have agreed a £42m fee with  Bayern Munich  for  Matthijs de Ligt  and are set to make the Netherlands defender their third summer signing.

De Ligt, who captained the Ajax team Erik ten Hag took to the Champions League semi-finals in 2019, is likely to become the second centre-back United have bought this year, after Leny Yoro.

The 24-year-old has been a target throughout the transfer window and United, who were reluctant to pay a huge fee, reached a breakthrough in talks with Bayern.

A horror moment for  Manchester United  veteran  Jonny Evans  gifted the Community Shield to Manchester  City  after a penalty shoot-out.

Evans lifted his spot-kick over the crossbar before Manuel Akanji tucked in the winning penalty as Pep Guardiola’s side secured the first silverware of the season.

Alejandro Garnacho thought he had inflicted more Wembley misery on the four-time Premier League winners when he repeated his FA Cup final goalscoring heroics from just 77 days earlier with nine minutes remaining.

Manchester United manager Erik ten Hag is last to speak to ITV. He says it was a  “tough result to take”.

“When the performance is right, when you lose, everyone feels this. It hurts in your stomach. You have to feel pain and we have to hurt. We have to take this belief in to the league.

“We did very good to produce the second goal in the FA Cup final before half-time and weren’t able to do that here,” he adds.

On Jadon Sancho, he says that the England winger “is a very good penalty taker and today he missed but that is part of the game”.

“We managed to be on an equal level with Man City and got [Marcus] Rashford high on the pitch and good defending. We created chances, we got pressure in the ball and in possession we had some very good chances from this, so there are many positives we can take,” he adds.

“The lesson is…it’s nice to play this game becausew you won something in the lats season. Now we see how the players come back, try and create a routine.

“It wasn’t easy. We played well, United got a bit better before it went to 1-0. Then it was a great cross from Oscar [Bobb] and Bernardo’s header.

“Ederson is probably the best penalty taker in our team, Erling [Haaland] as well. When Ederson takes the penalty I know it is a goal.

“I haven’t won the Community Shield yet so I’m really happy that I got this trophy as well and we look forward to hopefully win the next one soon.”

For  Erik ten Hag , the new start comes in the fixture that could have been his endgame. He could have bowed out against  Manchester City  at Wembley. Instead, reports of his demise proved exaggerated.  Manchester United  confounded expectations. He won the FA Cup and lost the sack race. Ten Hag’s reward was to keep his job,  with a one-year extension triggered , and another Manchester derby in London, two months later and after making two summer signings.

There can be a sense of renewal to United, but also one that the past is inescapable. Ten Hag had hoped that injuries would be consigned to last season but Leny Yoro seemed to exhibit the characteristics of a 2023-24 United centre-back by promptly getting injured: the £52m teenager’s debut will be delayed for three months.

With Tyrell Malacia out and a further four doubts, he  only has three senior defenders  guaranteed to be fit to face the champions.

The  Premier League  season is now barely a week away from starting - and while some clubs have done business already in preparation for 2024/25, there are no doubt lots of  transfers  still ahead before the window shuts at the end of the month.

While the likes of  Arsenal  and  Manchester United  have made moves in defence,  Chelsea  have added squad options everywhere and champions  Manchester City  have brought in one attacking reinforcement,  Liverpool have yet to do any incoming senior business at all, so expect that to change sooner or later at the very least.

Further down the table there are still moves in the works for West Ham, Tottenham, Newcastle and more, as top-flight teams look to get set for the campaign ahead.

Inquire about the company, clarify details about the job, clarify next steps, frequently asked questions about what to ask in an interview.

Asking questions in an interview gives you key insights and shows your interest in the opportunity. But you may be unsure what questions to ask or in what order.

The following guide can help. Read on for:

  • Sources you can use to research the job and generate targeted questions
  • Examples of great questions to ask in a job interview
  • Tips on deepening your discussion with the hiring manager

Your best interview questions will spring from any research you can do about the job and company beforehand. As time allows, prepare for each interview by closely reviewing these sources:

  • The job posting
  • The “About” page of the company’s website (as well as any parent company)
  • Any other relevant pages on the company’s website. These may include the main “Careers” page, which often has good general information on the advantages of working for the company. Key pages may also include a recent press release about a product launch or the home page for the team or department where you’d work.
  • Recent news articles about the company. Search in Google’s “News” tab, where you can specify a current date range by clicking the “Tools” button.
  • Business websites and publications like Bloomberg , Barron’s , Yahoo Finance , Financial Times , and the Wall Street Journal . These sites have individual pages and news updates for many midsize and large companies. (For any publications you don’t subscribe to that have paywalls, you may still be able to access full-text articles via your local library.)
  • Value Line reports on recent company mergers and developments. Ask your local library if it offers access to this paid resource.
  • General information about the company’s industry, sector, or products if you aren’t already familiar with them. When researching topics online, remember Wikipedia pages are unverified information, so you shouldn’t rely on them exclusively. But Wikipedia is often a great portal to official outside links and information.

Note: Also consider reviewing publicly available details about your interviewer, such as their bio on the company’s website or LinkedIn profile.

Reviewing information from the above sources, highlight anything that sparks your curiosity. Jot down a related question to ask during the interview.

For example, say you’re interviewing for an outside sales job. Through your research, you find a press release announcing that the company is working on an innovative new product category. But it’s unclear when the product will be officially launched or available to customers. You could ask:

  • I was intrigued to learn your team will be selling the [name] product class soon. Do you know when your company’s version will be hitting the market?

In addition to your research-backed questions, ask about an employer’s overall work culture and goals. This is often a great line of questioning toward the end of the interview. It places the job in context and shows you’re invested in the overall success of an organization. Also, it lets the interviewer give you more of their personal perspective, taking the conversation beyond the scope of detail in the job posting. Consider asking one or more of these questions:

  • How would you describe the company’s work culture?
  • Why do people enjoy working here? Why do you personally like working here?
  • How does the organization define success and evaluate employee performance?
  • What is the company’s core mission, and why? Do certain values or principles inform that mission?
  • How does the company define or distinguish itself from competitors?
  • What is the company’s overall strategy for staff training and professional development?
  • How does the organization incorporate ideas and requests from employees at different levels?
  • Does the company have a particular method for new product development and project management?
  • What is the management team’s leadership approach or philosophy?
  • How has the organization evolved during your tenure? What broad changes have you seen?
  • Where do you see the company headed in the short and long term? Are there broad changes underway that would affect my position?

If some of these questions seem forward, remember the basic purpose of a job interview: to figure out if you and the hiring company are a good fit. So you’ll need to answer the interviewer’s questions about your background. But it also means the interviewer will need to answer your questions about what it’s like to work there. Only by this two-way understanding can you each make a decision in everyone’s best interest.

Before each interview, jot down any remaining questions you have on the job itself. These will help you fill any information gaps on the job posting, giving you a clear sense of what the role entails. For example:

  • What does a typical workday look like for this position? Is there wide variation or a strong sense of routine?
  • What is the biggest or most frequent challenge for this position?
  • How is success in the position measured? What performance metrics are most closely evaluated by management?
  • Does the workflow tend to fluctuate annually or seasonally?
  • What is the expected or required ratio of time working at the office versus from home? (Note: When asking this question, emphasize your flexibility for different work schedules.)
  • Who does the position report to directly and indirectly? What is the expected level of contact or collaboration?
  • Is the role more independent or collaborative? If the latter, which team members or departments would I partner with most?

Always view these questions in light of your research and frame them accordingly. Below are two examples of how you could phrase a question in the context of research you’ve done:

  • In looking over your corporate website, I was struck by your expansion to five new markets in the past three years. Is that the biggest change in your time with the company so far?
  • I saw on the careers page that your company has a quarterly plan for formal staff training and development. Can you tell me more about how this plan works and how it applies to this department’s schedule?

At the end of your interview, inquire about next steps in the hiring process. Questions in this vein may include:

  • What is the timeframe for the next stage of hiring? If I’m selected, would there be another round of interviews?
  • Should I plan on hearing from you directly or from someone else once a decision has been made?
  • Should I expect to hear by phone or email? (But emphasize you’re flexible in this regard. Confirm the interviewer has your right contact information and knows the best times to reach you.)

What if the interviewer already answered most of my questions? -

Tell them so. When the interviewer asks if you have any questions for them, say something like, “I had some areas I was hoping to clarify, but we’ve covered most of them.” This type of comment is a courteous way to show the interviewer you were listening and the information they shared was helpful.

How can I deepen the interview discussion? -

Any question you ask is a yes/no, who, what, when, where, why, or how. Keep in mind “why” and “how” tend to open and enrich a conversation, while the others usually just provide facts and context.

For example, you could ask the interviewer when and where the company started. But when they answer plainly (“I believe the company was founded in Buffalo in the mid-1970s.”), the conversation may seem at a dead end. A more interesting way to learn from and engage with the interviewer is to ask them how the company has grown or evolved or why it’s been successful in its market.

What questions should I avoid asking? -

Any that are already answered in the job posting. When you ask for information the employer already provided, it tells them you haven’t fully prepared, and your interest in the position may be limited. To avoid this pitfall, closely review the job posting one more time right before each interview.
